12. The chat template and thinking mode

The model only knows tokens. "The user said this", "this turn is over", "think before answering" — all of it is marked by a few special tokens in the template. This chapter writes Qwen3.5's chat template by hand (we checked it: it matches the official chat_template.jinja token by token), builds a streaming Chat, and turns thinking mode on to watch the model "think".

After this chapter you can

  1. Write Qwen3.5's chat template by hand, say what each special token does, and what differs between thinking on and off.
  2. Write streaming output and know why the whole text is decoded again every time.
  3. Say what goes into the model at each turn of a multi-turn conversation, and why the second turn cannot reuse all the tokens the first turn computed.

What this chapter runs

ch12_chat.py, about 1 minute (four generations; the thinking-mode one is the longest). There is also ch12_turns.py, which needs no model (1 second), to see how much of a multi-turn conversation can be reused.

The template

The official template is a 300-line Jinja file (chat_template.jinja), most of it about tool calls and images. The conversation itself has only these rules:

  • every message: <|im_start|>role\ncontent<|im_end|>\n;
  • assistant turns in the history do not keep their thinking (<think>…</think> is removed);
  • finally <|im_start|>assistant\n, and then — with thinking on, write <think>\n so the model continues thinking; with thinking off, write an empty thinking block <think>\n\n</think>\n\n on its behalf.

def build_prompt(messages, thinking=False):

            text = self.tk.decode(out, skip_special_tokens=False) # re-decode the whole text every time: one character may be split across two tokens
            if stream and not text.endswith(""):
                print(text[len(printed):], end="", flush=True)
                printed = text

        generate(self.model, ids, stop=self.stop, on_token=on_token, **kw)
        if stream:
            print()
        return self.tk.decode(out, skip_special_tokens=False)

The streaming in Chat.ask has one subtlety: a Chinese character may be split across two tokens (its three UTF-8 bytes in two tokens), and decoding one of them alone gives . So every new token triggers a re-decode of the whole text, only the new part is printed, and a trailing is held back.

Thinking Process:

1. **Analyze the Request:** The user is asking which number is larger between 9.11 and 9.8.

2.  **Identify the Numbers:**
    *   Number A: 9.11
    *   Number B: 9.8

3.  **Compare the Numbers:**
    * Both numbers have the same integer part (9).
    *   Compare the decimal parts:
        *   9.11 has a tenths digit of 1.
        *   9.8 has a tenths digit of 8.
    *   Since 8 > 1, 9.8 is greater than 9.11.

--- 多轮:第二轮带着第一轮的问答

The first lines lay the template open: thinking off is 2 tokens longer than thinking on — the \n\n</think>\n\n stretch closes the thinking block on the model's behalf; the assistant turn in the history keeps only the answer "2", its thinking removed; <|im_start|> and the other special tokens are single tokens whose ids sit at the very end of the vocabulary. In thinking mode the model's output starts with a <think> block holding its reasoning, and the answer comes after </think>; the 160-token limit cuts it off here, in real use let it finish. Multi-turn chat is simply the history re-assembled with the template and prefilled once more — chapter 10 mentioned that inference engines use prefix caching to skip the repeated computation.

Multi-turn: how much of the second turn can be reused

Every turn, Chat.ask puts the whole conversation through the template and prefills it from scratch: the model itself does not remember the previous turn; "remembering" means sending the history along every time. A real inference engine keeps the KV computed in the previous turn (the prefix cache), and as long as the start of the second turn's prompt is identical to the previous one, that part need not be recomputed. So how much can be reused?

output

The first turn computed KV for 39 tokens, and the second turn reuses only the first 24: it breaks at the start of the first turn's answer. The first turn's prompt ends with <|im_start|>assistant\n plus an empty thinking block, and the model writes its answer after that; in the second turn this exchange is history, and the template writes only <|im_start|>assistant\n plus the answer, without the empty thinking block. Once those few tokens differ, the answer after them is shifted even though it is identical word for word, so it has to be recomputed. Thinking on is no different: the thinking of history turns is removed (as explained with the template above), and the cache again breaks at the start of the assistant turn.

For a plain question-and-answer chat, recomputing one answer costs little; for an agent that calls tools, every tool result means another turn, and the prompt also carries long tool definitions, so whether it can be reused matters a lot. The serving handbook's chapter Inference under agent workloads picks up from here: how real engines reuse it, where it breaks, how to schedule it.

Common questions

For a follow-up question, is the new question appended to everything before it, prefilled again, then decoded?

Yes: every turn the model sees "the whole history + the new question". The only difference is the engine: without a prefix cache the whole thing is prefilled again (as this chapter's Chat does); with one, the part that starts the same as the previous turn comes straight from the cache, only the differing part after it is prefilled, and then decoding proceeds as usual.

Why does the template delete the thinking from the history?

Thinking is often long, so keeping it in the history would crowd the context, and in the official training data history turns contain no thinking either. The price of deleting it is that the previous answer moves in the second turn and has to be computed again.

How to explain it

The core sentence about chat templates: the structure of the conversation is encoded into the sequence with special tokens, and after pretraining the model is trained to "start answering when it sees <|im_start|>assistant and emit <|im_end|> when done". Thinking mode is just part of the template: a leading <think> lets the model continue thinking; to turn it off, write an empty thinking block for it. Then the engineering trap: with a wrong template (an extra newline, a missing space) the model still answers, but worse — so compare with the official template token by token.

Summary

  • The template = <|im_start|>role\ncontent<|im_end|>\n per message + the start of the assistant turn; thinking on/off differs only by an empty <think> block.
  • The hand-written template was checked against the official Jinja template token by token; assistant turns in the history keep only the answer, the thinking never enters the next turn's context.
  • Chat.ask: streaming (re-decode the whole text to avoid half a character), thinking mode, multi-turn.
  • Every turn of a multi-turn conversation sends the whole history; the template rewrites the history turns (removing the thinking block), so the second turn can only reuse part of what the first computed, breaking at the start of the previous answer.

Questions

1. The second turn's prompt has 53 tokens, of which the first 24 can be reused. With a prefix cache, how many must the second turn prefill? Without one?

Answer

With a prefix cache: 53 − 24 = 29 (the previous answer's 11 tokens are recomputed, plus the new question). Without a cache: all 53 are recomputed. The more turns and the longer the history, the bigger the gap.

2. If the template kept that empty thinking block in history turns, how much of the second turn could be reused?

Answer

All 39 tokens the first turn computed (28 of prompt + 11 of answer, ending with <|im_end|>) would match the start of the second turn; only the newline after <|im_end|> and the new question would need prefilling. The price is a few meaningless tokens in the history, and a format different from what the model saw in training.
